Local AI for Image Generation: Stable Diffusion + LLM Prompting

Combining a local LLM with Stable Diffusion creates a powerful content pipeline: the LLM generates detailed image prompts from natural language descriptions, and Stable Diffusion renders them. This workflow is increasingly used for content creation, prototyping, and creative projects — all running completely offline on your hardware.

Minimum hardware: 8GB VRAM runs both a 7B LLM and SDXL (though not simultaneously without compromise). For dedicated AI art hardware recommendations, LLMHardware.io covers image generation GPUs alongside LLM specs.

The LLM-to-Image Pipeline

The workflow: user provides a natural language description ("a futuristic city at dusk, cyberpunk style") → LLM expands it into a detailed Stable Diffusion prompt with art style keywords, lighting descriptions, and quality tags → prompt sent to Automatic1111, ComfyUI, or InvokeAI → image generated. The LLM dramatically improves image quality by understanding what Stable Diffusion responds to vs. what it ignores.

Prompt Expansion with Ollama

System prompt for LLM: "You are a Stable Diffusion prompt expert. Convert the user's description into an optimized prompt. Include: art style, lighting, camera angle, quality tags (masterpiece, highly detailed), and negative keywords. Respond with only the positive prompt on one line, then negative prompt on the next line, nothing else." Mistral 7B works well for this task; the structured output format benefits from models with good instruction following.

Tools for This Workflow

Open WebUI has image generation integration built in — connect it to your Automatic1111 instance and generate images directly in the chat interface. ComfyUI has LLM nodes via ComfyUI-LLM that call Ollama directly in a workflow graph. Stable Diffusion WebUI Forge (the latest Automatic1111 fork) significantly improves SDXL performance and has better memory management for running alongside an LLM inference server.
